I | am | learning | mathematics

हर step पर वह वर्तमान token और पिछले step की hidden state का उपयोग करके नई hidden state बनाता है।

ht=f(xt,ht−1)h_t = f(x_t, h_{t-1})ht=f(xt,ht−1)

Paper

4. Token से Vector तक: Embedding

Transformers are useful

["Transform", "ers", "are", "useful"]

token→embedding vector\text{token} \rightarrow \text{embedding vector}token→embedding vector

5. Attention

Q=XWQ,K=XWK,V=XWVˆQ=XW^Q,\qquad K=XW^K,\qquad V=XW\^VQ=XWQ,K=XWK,V=XWVˆ

यहाँ (W^Q), (W^K), (W^V) learned weight matrices हैं।

7. Scaled Dot-Product Attention

Attention⁡(Q,K,V)=softmax⁡(QKTdk)V\operatorname{Attention}(Q,K,V) = \operatorname{softmax}\left(\frac{QK^T}{\sqrt{d_k}}\right)VAttention(Q,K,V)=softmax(dkQKT)V

QKTˆQK\^TQKTˆ

2: Scaling

QKTdk\frac{QK^T}{\sqrt{d_k}}dkQKT

3: Softmax

αi=esi∑jesj\alpha_i = \frac{e^{s_i}}{\sum_j e^{s_j}}αi=∑jesjesi

∑iαiVi\sum_i \alpha_i V_i∑iαiVi

Position Attention weight

Output

0.70V1+0.20V2+0.10V30.70V_1+0.20V_2+0.10V_30.70V1+0.20V2+0.10V3

8. Self-Attention और Cross-Attention

Self-Attention

The animal didn't cross the street because it was tired."

Cross-Attention

head⁡i=Attention⁡(QWiQ,KWiK,VWiVˆ)\operatorname{head}_i = \operatorname{Attention}(QW_i^Q,KW_i^K,VW_i\^V)headi=Attention(QWiQ,KWiK,VWiVˆ)

MultiHead⁡(Q,K,V)=Concat⁡(head⁡1,…,head⁡h)WOˆ\operatorname{MultiHead}(Q,K,V) = \operatorname{Concat}(\operatorname{head}_1,\ldots,\operatorname{head}_h)W\^OMultiHead(Q,K,V)=Concat(head1,…,headh)WOˆ

10. Positional Encoding:

Input representation=Token Embedding+Positional Encoding\text{Input representation} = \text{Token Embedding} + \text{Positional Encoding}Input representation=Token Embedding+Positional Encoding

PE(pos,2i)=sin⁡(pos100002i/dmodel)PE_{(pos,2i)} = \sin\left(\frac{pos}{10000^{2i/d_{\text{model}}}}\right)PE(pos,2i)=sin(100002i/dmodelpos) PE(pos,2i+1)=cos⁡(pos100002i/dmodel)PE_{(pos,2i+1)} = \cos\left(\frac{pos}{10000^{2i/d_{\text{model}}}}\right)PE(pos,2i+1)=cos(100002i/dmodelpos)

11. मूल Transformer का Encoder--Decoder Architecture

Encoder layer का सरल flow`Input representations` → `Multi-Head Self-Attention` → `Add & Norm` → `Feed-Forward Network` → `Add & Norm`

Decoder layer का सरल flow`Previous output tokens` → `Masked Self-Attention` → `Add & Norm` → `Encoder–Decoder Cross-Attention` → `Add & Norm` → `Feed-Forward Network` → `Add & Norm`

Encoder

  1. Multi-Head Self-Attention;
  2. Position-wise Feed-Forward Network।

Decoder

  1. Masked Multi-Head Self-Attention;
  2. Encoder--Decoder Cross-Attention;
  3. Position-wise Feed-Forward Network।

Query position Position 1 Position 2 Position 3

FFN⁡(x)=max⁡(0,xW1+b1)W2+b2\operatorname{FFN}(x) = \max(0,xW_1+b_1)W_2+b_2FFN(x)=max(0,xW1+b1)W2+b2

Base Transformer

14. Residual Connection और Layer Normalization

LayerNorm⁡(x+Sublayer⁡(x)) \operatorname{LayerNorm}(x+\operatorname{Sublayer}(x))LayerNorm(x+Sublayer(x))

RNN में सामान्यतः sequence की position (t) की hidden state, position (t-1) की state पर निर्भर करती है।

18. "Attention Is All You Need"

21. Feynman Technique:

Attention Is All You Need
